Climate change is one of the most pressing issues of our time—complex, deeply interconnected, and often poorly understood by the public. There’s currently no intuitive, interactive way to simulate real-world climate outcomes, ask meaningful “what if” questions, or visualize the large-scale impact of human and natural interactions.

Challenges we ran into

Our project presented three main technical challenges that required systematic problem-solving approaches.

Data acquisition proved complex. We evaluated multiple public datasets but found most either outdated, insufficient in size, or misaligned with our specific requirements. We addressed this by combining three separate data sources, implementing comprehensive preprocessing pipelines to standardize formats and handle missing values. The labeling process required establishing clear ground truth criteria and validation protocols to ensure data quality.

Model performance optimization was iterative. Initial baseline models achieved suboptimal accuracy, necessitating extensive experimentation with different algorithms including random forests, gradient boosting, and neural networks. We implemented systematic hyperparameter tuning using grid search and cross-validation techniques. Feature engineering became crucial—we tested various combinations, applied dimensionality reduction, and used regularization methods to improve generalization on unseen data.

Deployment constraints forced architectural changes. Our initial monolithic FastAPI application exceeded Railway's resource limits due to large ML dependencies and model files. We resolved this by implementing a microservices architecture, separating model inference, data processing, and API endpoints into independent services. This approach reduced individual service sizes below deployment thresholds while improving system maintainability and enabling horizontal scaling.

Each challenge required technical solutions that ultimately strengthened our understanding of end-to-end ML workflows and production considerations.
